It's all about chemistry🔬! Capsaicin is a compound contained in chilies that attaches to your receptors and causes pain.

Milk🥛, on the other hand, contains the compound casein that binds with capsaicin and helps wash it away.

Water 💦 doesn't quite do the trick since it doesn't contain casein.
